A high-volume FinTech application suffered from transaction fraud and chargebacks that were only detected weeks after they occurred during manual compliance reviews. The business had no system to flag risky transactions in real time, leading to significant revenue loss, excessive dispute administration fees, and heightened risk of regulatory compliance penalties. Our strategy was to shift fraud detection from a reactive, monthly audit process to a proactive, real-time scoring system that evaluates every transaction at the moment it happens.
The fundamental flaw in the existing process was timing — by the time fraud was identified manually, the money was already gone. We needed to insert an intelligent layer of protection directly into the payment pipeline, one that evaluates risk in milliseconds without slowing down legitimate transactions.
We adopted a "dual-model defense" strategy:
→ Catch the Unknown: Use an unsupervised Isolation Forest model to detect anomalies that don't match any known fraud pattern — protecting against brand-new attack vectors.
→ Catch the Known: Train an XGBoost classifier on historical fraud records to identify confirmed fraud signatures with high precision.
→ Act Instantly: Serve both models through a high-speed Flask API that scores transactions in real time and fires immediate alerts.
How we executed this strategy:
1. We analyzed two years of transaction history to engineer predictive features — transaction velocity, geolocation anomalies, device fingerprints, and spending pattern deviations.
2. An Isolation Forest model was trained to flag statistical outliers that deviate from a user's normal behavior — catching zero-day fraud patterns.
3. An XGBoost classifier was trained and tuned on labeled historical fraud cases, achieving 94% detection accuracy.
4. Both models were packaged inside a Flask REST API that plugs directly into the payment gateway — every transaction is scored in under 200ms.
5. A Power BI alert dashboard gives the risk team a real-time view of flagged transactions, geographic clusters, and fraud trend timelines.
The business went from discovering fraud weeks later to intervening before the transaction settles.
